Sampling the XY model with an attention-based neural network

Abstract

We present a transformer-based variational autoregressive network for sampling lattice systems with continuous degrees of freedom and apply it to the two-dimensional XY model near the Berezinskii-Kosterlitz-Thouless transition. The architecture is combined with physics-informed ingredients: locality-informed attention and approximate probabilities. The resulting sampler significantly outperforms existing neural samplers. We train the model on lattices up to $96\times96$, verify with a mode-dropping estimator that no parts of the configuration space are missed, and reproduce the energy, magnetization and helicity modulus obtained with the traditional Markov Chain Monte Carlo algorithm.

Attention over noisy examples: generalization and memorization in the exponential Hopfield network

In Hebbian learning from examples, a Hopfield network retrieves archetypes seen only through noisy examples. We study it in the exponential Hopfield model: one softmax attention step with the unlabelled examples as keys. A signal-to-noise analysis gives the overlap with an unseen archetype in closed form: a majority-rule law in which an attention entropy replaces the dataset entropy. At high temperature the archetype is lost in the crosstalk; at low temperature the softmax freezes on the closest training example, as in a random energy model, and the layer memorizes. In between, in a window widening with the square root of the network size, the layer pools the examples of the correct class and retrieves the unseen archetype as well as their majority vote allows, at any fixed load. On structured datasets, such as MNIST and fashion-MNIST, the best accuracy lies beyond the freezing.

Signed FK percolation in Ising spin glasses

We introduce signed Fortuin-Kasteleyn (FK) percolation for the +/-J random-interaction Ising model to characterize nonzero uniform magnetization density and two-replica overlap within the class of Gibbs distributions whose infinite-volume Edwards-Sokal (ES)/FK representation has at most one infinite FK cluster almost surely. The construction refines ordinary FK connectivity by retaining the parity of coupling products along open paths. Using the infinite-volume ES representation and its DLR equations, we study pairs of companion objects and the compatible spin assignments on them. In one replica, companions are defined by positive-parity FK connections. For extremal states satisfying the infinite-cluster assumption and almost-sure existence of companion densities along the chosen van Hove sequence, nonzero limiting expected magnetization density is equivalent to density distinguishability of the companions of the infinite FK cluster. For two independent replicas, companions are defined by FK connections coherent in parity. For products of extremal one-replica states satisfying the infinite-cluster assumption and almost-sure existence of the companion densities along the chosen sequence, density distinguishability of the companions is equivalent to nonzero limiting expected mutual overlap. For two independent replicas drawn from the same extremal state, this specializes to the Edwards-Anderson self-overlap.

Seismology of Glasses

Aging and relaxation of glasses proceed through localized rearrangements that also generate long-ranged mechanical responses in their surroundings. We develop a theory that treats these rearrangements as internal microseismic sources, and thereby separates the direct effects emerging from an event from the effects from the far-field displacements it generates. These far-field disturbances propagate and relax through the viscoelastic medium through which they move, producing a stochastic background of weak but numerous perturbations at any given location. Combining the description of local events from the Random First Order Transition theory with this propagating background, we derive a unified equation for the dynamical structure factor of a relaxing glass. The theory identifies a finite wave-vector and time window in which the growing viscoelastic far-field disturbances can produce compressed exponential relaxation, which has been observed using X-ray photon correlation spectroscopy. At higher wave vectors that resolve local jumps, heterogeneity of the local event dynamics instead produces stretched exponential relaxation. The crossover between these behaviors depends on the event statistics and the scattering phase accumulated across the region reached through viscoelastic propagation from the numerous distant sources.
